Hopfield net as associative memory

See Chapter 17 Section 2 for an introduction to Hopfield networks. Hopfield networks can be analyzed mathematically. In this Python exercise we focus on visualization and simulation to develop our intuition about Hopfield dynamics.

We provide a couple of functions to easily create patterns, store them in the network and visualize the network dynamics. If you instantiate a new object of class network. That is, all states are updated at the same time using the sign function.

We use this dynamics in all exercises described below. Run the following code. Read the inline comments and check the documentation. The patterns and the flipped pixels are randomly chosen. Therefore the result changes every time you execute this code.

Then, the dynamics recover pattern P0 in 5 iterations. The network state is a vector of N neurons. For visualization we use 2d patterns which are two dimensional numpy. The network can store a certain number of pixel patterns, which is to be investigated in this exercise.

During a retrieval phase, the network is started with some initial configuration and the network dynamics evolves towards the stored pattern attractor which is closest to the initial configuration. In the Hopfield model each neuron is connected to every other neuron full connectivity. The connection matrix is. This is a simple correlation based learning rule Hebbian learning. Since it is not a iterative rule it is sometimes called one-shot learning.

In a large networks N to infinity the number of random patterns that can be stored is approximately 0.

The units in Hopfield nets are binary threshold units, i. Hopfield nets normally have units that take on values of 1 or -1, and this convention will be used throughout this article. However, other literature might use units that take values of 0 and 1.

The constraint that weights are symmetric guarantees that the energy function decreases monotonically while following the activation rules.

Updating one unit node in the graph simulating the artificial neuron in the Hopfield network is performed using the following rule:. The weight between two units has a powerful impact upon the values of the neurons. Thus, the values of neurons i and j will converge if the weight between them is positive. Similarly, they will diverge if the weight is negative. Bruck shed light on the behavior of a neuron in the discrete Hopfield network when proving its convergence in his paper in Bruck shows [6] that neuron j changes its state if and only if it further decreases the following biased pseudo-cut.

The discrete Hopfield network minimizes the following biased pseudo-cut [7] for the synaptic weight matrix of the Hopfield net.

For further details, see the recent paper [7]. The complex Hopfield network, on the other hand, generally tends to minimize the so-called shadow-cut of the complex weight matrix of the net [8]. Hopfield nets have a scalar value associated with each state of the network, referred to as the "energy", E, of the network, where:. This quantity is called "energy" because it either decreases or stays the same upon network units being updated.

Furthermore, under repeated updating the network will eventually converge to a state which is a local minimum in the energy function [ citation needed ] which is considered to be a Lyapunov function. Thus, if a state is a local minimum in the energy function it is a stable state for the network. Note that this energy function belongs to a general class of models in physics under the name of Ising models ; these in turn are a special case of Markov networkssince the associated probability measurethe Gibbs measurehas the Markov property.

Associative memory is memory that is addressed through its contents.

Hopfield Networks is All You Need

That is, if a pattern is presented to an associative memory, it returns whether this pattern coincides with a stored pattern. The coincidence need not be perfect, though. An associative memory may also return a stored pattern that is similar to the presented one, so that noisy input can also be recognized. Hopfield networks are used as associative memory by exploiting the property that they possess stable states, one of which is reached by carrying out the normal computations of a Hopfield network.

If the connection weights of the network are determined in such a way that the patterns to be stored become the stable states of the network, a Hopfield network produces for any input pattern a similar stored pattern. Thus noisy patterns can be corrected or distorted patterns can still be recognized. Details about the structure of a Hopfield network and about how to construct a Hopfield network that stores given patterns can be found in most textbooks on artificial neural networks.

With the programs xhfn and whfn the storage and retrieval of simple two-dimensional bit patterns in a Hopfield networks can be demonstrated.

The main window of the program displays a grid of neurons. The fields of this grid are colored according to the activation of the corresponding neuron: grey corresponds to an activation of 1, white to an activation of The activation of a neuron may be changed by clicking on the corresponding field.

In this way a pattern can be entered. Once all desired patterns have been stored, the retrieval capacities of the network may be tested. The update process then brings the network into a stable state, which hopefully is the stored pattern that is similar to the one entered. It may, however, also converge to a spurious stable state that is not similar to any stored pattern.

As an example, let us consider the set of eight characters shown below. However, the reconstruction is not always perfect. Due to the method used to store the patterns, the complement of the stored patterns are also stable states, so that sometimes such a complement is reached. In addition there are some spurious stable states that do not correspond exactly to stored patterns. In the first two input fields the width and the height of the Hopfield network may be entered.

The third field allows a specification of the size of the square that is used to visualize the activation of a neuron. The update mode is either "single neuron", which means that the Hopfield network is redisplayed after each update of a neuron, or "all neurons", which means that the Hopfield network is redisplayed only after all neurons have been updated. The delay value controls the amount of time that has to pass between to redisplays of the Hopfield network, so that the computations can be followed conveniently.

A Hopfield network or rather the set of stored patterns can be saved to a file and reloaded later. The file selector box that is opened, if one of these menu entries are selected, is shown below. In the Windows version the standard Windows file selector box is used.

When the file name pattern has been changed, pressing the 'Update' button updates the file list.Modern neural networks is just playing with matrices. So in a few words, Hopfield recurrent artificial neural network shown in Fig 1 is not an exception and is a customizable matrix of weights which is used to find the local minimum recognize a pattern. The Hopfield model accounts for associative memory through the incorporation of memory vectors and is commonly used for pattern classification.

A Hopfield network is a form of recurrent artificial neural network popularized by John Hopfield in but described earlier by Little in Hopfield nets serve as content-addressable memory systems with binary threshold nodes. They are guaranteed to converge to a local minimum, but convergence to a false pattern wrong local minimum rather than the stored pattern expected local minimum can occur.

Hopfield networks also provide a model for understanding human memory. A Hopfield neural network is a particular case of a Little neural network. So it will be interesting to learn a Little neural network after. A Hopfield neural network is a recurrent neural network what means the output of one full direct operation is the input of the following network operations, as shown in Fig 1.

It has been proved that Hopfield network is resistant. In general, it can be more than one fixed point.

hopfield net as associative memory

What fixed point will network converge to, depends on the starting point chosen for the initial iteration. The fixed points called attractors.

The set of fixed points of the Hopfield network — is its memory. In this case, the network can act as an associative memory. Those input vectors that fall within the sphere of attraction of a separate attractor, are related associated with them. For example, the attractor may be some desired pattern. Attraction area may consist of noisy or incomplete versions of this pattern.

Zero diagonal is a recommended condition for the convergence, but not the required one. It is hoped that these instances are fixed points of the resulting network Hopfield.

Although this is not always the case. If instances of the vectors form a set of orthogonal vectors, it is possible to ensure that if the weight matrix is chosen as indicated above, each copy of the vector is a fixed point. However, in general, in order to instances lead to fixed points, orthogonality is not required. Furthermore, under repeated updating, the network will eventually converge to a state which is a local minimum in the energy function. The input vector X is multiplied by the weight matrix using the normal matrix-vector multiplication.

However, only one component of the output vector is used at each iteration.Skip to search form Skip to main content You are currently offline. Some features of the site may not work correctly.

We study how a network stores and retrieve patterns. Using a small network of only 16 neurons allows us to have a close look at the network weights and dynamics. Now test whether the network can still retrieve the pattern if we increase the number of flipped pixels. The patterns a Hopfield network learns are not stored explicitly. Instead, the network learns by adjusting the weights to the pattern set it is presented during learning. The mapping of the 2-dimensional patterns onto the one-dimensional list of network neurons is internal to the implementation of the network.

You cannot know which pixel x,y in the pattern corresponds to which network neuron i. You can easily plot a histogram by adding the following two lines to your script. Larger networks can store more patterns. There is a theoretical limit: the capacity of the Hopfield network. A Hopfield network implements so called associative or content-adressable memory. Explain what this means.

Then initialize the network with the unchanged checkerboard pattern. Let the network evolve for five iterations. In the previous exercises we used random patterns. Now we us a list of structured patterns: the letters A to Z. Each letter is represented in a 10 by 10 grid. Read the inline comments and look up the doc of functions you do not know.
